Of course, all AI writing software needs human supervision to deliver the best results. Left to its own devices, it tends to produce fairly generic and frequently incorrect content, even if it can pass for something a human wrote. Now that AI tools are increasingly popular, people also seem more aware of what bland AI-produced content reads like and are likely to spot it—or at least be suspicious of content that feels like it lacks something.

I've been covering this kind of generative AI technology for almost a decade. Since AI is supposedly trying to take my job, I'm somewhat professionally interested in the whole situation. Still, I think I'm pretty safe for now. These AI writing tools are getting incredibly impressive, but you have to work with them, rather than just letting them spit out whatever they want.

So, if you're looking for an AI content generator that will help you write compelling copy, publish blog posts a lot quicker, and otherwise take some of the slow-paced typing out of writing, you've come to the right place. Let's dig in.

How do AI writing tools work?

Search Google for AI writing software, and you'll find dozens of different options, all with suspiciously similar features. There's a big reason for this: 95% of these AI writing tools use the same large language models (LLMs) as the back end.

Some of the bigger apps are also integrating their own fine-tuning or using other LLMs like Claude . But most are really just wrappers connected to OpenAI's GPT-3 and GPT-4 APIs, with a few extra features built on top—even if they try to hide it in their own marketing materials. If you wanted to, you could even create your own version of an AI writing assistant without code using Zapier's OpenAI integrations —that's how much these apps rely on GPT.

Now this isn't to say that none of these AI-powered writing apps are worth using. They all offer a much nicer workflow than ChatGPT or OpenAI's playground , both of which allow you to generate text with GPT as well. And the better apps allow you to set a "voice" or guidelines that apply to all the text you generate. But the difference between these apps isn't really in the quality of their output. With a few exceptions, you'll get very similar results from the same prompt no matter which app you use—even if they use different LLMs. Where the apps on this list stand out is in how easy they make it to integrate AI text generation into an actual workflow.

As for the underlying LLM models themselves, they work by taking a prompt from you, and then predicting what words will best follow on from your request, based on the data they were trained on. That training data includes books, articles, and other documents across all different topics, styles, and genres—and an unbelievable amount of content scraped from the open internet . Basically, LLMs were allowed to crunch through the sum total of human knowledge to form a deep learning neural network—a complex, many-layered, weighted algorithm modeled after the human brain. Yes, that's the kind of thing you have to do to create a computer program that generates bad poems .

What makes the best AI text generator?

How we evaluate and test apps.

Our best apps roundups are written by humans who've spent much of their careers using, testing, and writing about software. Unless explicitly stated, we spend dozens of hours researching and testing apps, using each app as it's intended to be used and evaluating it against the criteria we set for the category. We're never paid for placement in our articles from any app or for links to any site—we value the trust readers put in us to offer authentic evaluations of the categories and apps we review. We know that most AI text generators rely on the various versions of GPT, and even those that don't are using very similar models, so most apps aren't going to stand out because of some dramatic difference in the quality of their output. Creating effective, human-like text is now table stakes. It was required for inclusion on this list—but not sufficient on its own.

As I was testing these apps, here's what else I was looking for:

Tools powered by GPT or a similar large language model with well-documented efficacy. In practice, this means that most but not all of the AI writing tools on this list use GPT to a greater or lesser degree. Many apps are starting to hide what models they use and claim to have a lot of secret sauce built on top (because there's a marketing advantage in being different and more powerful), but the reality is that nine times out of ten, it's the GPT API that's doing the heavy lifting.

An interface that gives you a lot of control over the text output. The more options you have to influence the tone, style, language, content, and everything else, the better. I didn't want tools where you just entered a headline and let the AI do the rest; these are all tools that you collaborate with, so you can write great copy quickly. The best AI writing tools also let you set a default brand voice that's always on.

Ease of use. You shouldn't have to fight to get the AI to do what you want. With AI writing software like this, there will always be some redoing and reshaping to get the exact output you want, but working with the AI shouldn't feel like wrangling a loose horse. Similarly, great help docs and good onboarding were both a major plus. 

Affordability. ChatGPT is currently free, and all these tools are built on top of an API that costs pennies . There was no hard and fast price limit, but the more expensive tools had to justify the extra expense with better features and a nicer app. After all, almost every app will produce pretty similar outputs regardless of what it costs. 

Apps that weren't designed to make spam content. Previous text-generating tools could " spin " content by changing words to synonyms so that unscrupulous website owners could rip off copyrighted material and generally create lots of low-quality, low-value content. None of that on this list.

Even with these criteria, I had more than 40 different AI writing tools to test. Remember: it's relatively easy for a skilled developer to build a wrapper around the GPT API, so I had to dig deep into each one to find out if it was any good or just had a flashy marketing site.

I tested each app by getting it to write a number of different short- and long-form bits of copy, but as expected, there were very few meaningful quality differences. Instead, it was the overall user experience, depth of features, and affordability that determined whether an app made this list.

Jasper (formerly Jarvis) is one of the most feature-filled and powerful AI content generators. It was among the first wave of apps built on top of GPT, and its relative longevity means that it feels like a more mature tool than most of the other apps I tested. It's continued to grow and develop in the months since I first compiled this list.

If you have a business and budget isn't your primary concern, Jasper should be one of the first apps you try. It's pivoted to mostly focus on marketing campaigns rather than just generating generic AI content. That's not a bad thing, but it means that plans now start at $49/month for individual creators and $125/month for teams.

Jasper has also moved away from just being a GPT app. It claims to combine "several large language models" including GPT-4, Claude 2, and PaLM 2, so that "you get the highest quality outputs and superior uptime." While I can't say that I noticed a massive difference between Jasper's output and any other app's, it does give you a few solid controls so that your content matches your brand. 

You can create a brand Voice and Tone by uploading some appropriate sample text. Based on a few examples of my writing, Jasper created a style that "emphasizes a casual, conversational tone with humor, personal anecdotes, listicles, informal language, expertise in various subjects, and a call to action for an engaging and approachable brand voice." I don't think that's a bad summary of the content I fed in, and its output for a few test blog posts like "The Enduring Popularity of Top Gun" felt closer to my writing than when I asked it to use a generic casual tone of voice. Similarly, there's a Knowledge Base where you can add facts about your business and products so Jasper gets important details right. 

While other apps also offer similar features, Jasper's seemed to work better and are fully integrated with the rest of the app. For example, you can create entire marketing campaigns using your custom brand voice. Put a bit of work into fine-tuning it and uploading the right assets to your knowledge base, and I suspect that Jasper really could create some solid first drafts of marketing materials like blog outlines, social media campaign ads, and the like.

Otherwise, Jasper rounds things out with some nice integrations. It has a built-in ChatGPT competitor and AI art generator (though, again, lots of other apps have both), plays nice with the SEO app Surfer , and there's a browser extension to bring Jasper everywhere.

Pretty much anything Jasper can do, Copy.ai can do too. It has brand voices, an infobase, a chatbot, and team features (though there isn't a browser extension). Consider it the Burger King to Jasper's McDonalds.

And like the Home of the Whopper, Copy.ai appeals to slightly different tastes. While I could argue that Copy.ai has a nicer layout, the reality is it's geared toward a slightly different workflow. While Jasper lets you and the AI loose, Copy.ai slows things down a touch and encourages you to work with its chatbot or use a template that asks some deliberate, probing questions. For creating website copy, social media captions , product descriptions, and similarly specific things, it makes more sense. But for content marketing blog posts and other long-form content, it might annoy you.

The other big difference is the pricing. While both offer plans for $49/month, Copy.ai includes five user seats and unlimited brand voices. For a small team working with multiple brands, it can be a lot cheaper. Also, if you're looking for a free AI writing generator, Copy.ai also offers a free plan that includes 2,000 words per month.

Overall, there are more similarities than differences between Jasper and Copy.ai , and both can create almost all the same kinds of text. Even when it came to analyzing my voice, they both came to pretty similar conclusions. Copy.ai decided that, to mimic me, it had to "focus on creating content that is both educational and entertaining, using a conversational tone that makes readers feel like they're having a chat with a knowledgeable friend" and "not to be afraid to inject some humor or personal anecdotes." If you're in doubt, try them both out and then decide.

While you can direct the AI to include certain details and mention specific facts for every app on this list, none make it as easy as Anyword. More than any of the others, the AI here feels like an eager and moderately competent underling that requires a bit of micromanaging (and can also try to mimic your writing style and brand voice), rather than a beast that you have to tame with arcane prompts. 

Take one of its main content-generating tools: the Blog Wizard. Like with Copy.ai, the setup process requires you to describe the blog post you want the AI to create and add any SEO keywords you want to target. Anyword then generates a range of titles for you to choose from, along with a predicted engagement score. 

Once you've chosen a title—or written your own—it generates a suggested outline. Approve it, and you get the option for it to create an entire ~2,000-word blog post (boo!) or a blank document where you can prompt it with additional instructions for each section of the outline, telling it things like what facts to mention, what style to take, and what details to cover. There's also a chatbot-like research sidebar that you can ask questions of and solicit input from. While certainly a slower process than most apps, it gives you a serious amount of control over the content you're creating.

Anyword is definitely aimed at marketers, and its other tools—like the Data-Driven Editor and the Website Targeted Message—all allow you to target your content toward specific audiences and give things engagement scores. While I certainly can't confirm the validity of any of these scores, they at least pass the sniff test. I generally thought the AI-generated content that Anyword scored higher was better—and even when I disagreed, I still liked one of the top options.

Very controversial in fiction writing circles

When I saw Sudowrite's marketing copy, I didn't think for a second it would make it onto this list. Then I tried it and
I kind of love it. Sudowrite is a totally different tool than all the others on this list because it's aimed at fiction writers. And with that, comes a lot of controversy. Sudowrite has been called " an insult to writers everywhere " and has been generally dismissed as a tool for hacks by a lot of Very Online writers. And while it's true that it's nowhere close to replacing a human author, it's fun, functional, and can genuinely help with writing a work of fiction. 

The Story Engine feature, which allows you to generate a full work of fiction over a few days by progressively generating each story beat, has attracted the most attention ( it works but takes lots of hand-holding and your novel will be weird ). But I prefer its assistive tools.

Let's start with Describe. Select a word or phrase, click Describe , and the AI will generate a few suggestions for the sight, smell, taste, sound, and touch of the thing, as well as a couple of metaphors. If you're the kind of writer who struggles to add sensory depth to your short stories, it can help you get into the habit of describing things in more interesting ways.

Then there's Brainstorm. It allows you to use the AI to generate possible dialogue options, character names and traits, plot points, places, and other details about your world from your descriptions and cues. If you know you want a big hairy guy with a huge sword but can't think of a good name, it can suggest a few, like Thorgrim and Bohart.

And these are just scratching the surface. Sure, if you over-rely on the AI to solve all your problems, you'll probably end up with an impressively generic story. But if you use it as a writing buddy to bounce ideas off and get you out of a rut, it's got serious potential. 

Best of all, Sudowrite is super easy to use. The onboarding, tool tips, and general helpful vibe of the app are something other developers could learn from.

Best AI text generator for a non-GPT option

Writer (web).

Writer, our pick for the best AI writing generator that doesn't use GPT

Writer pros:

Not based on GPT, so free of a lot of the controversy surrounding LLMs

Surprisingly capable as an editor, making sure your team sticks to the style guide and doesn't make any wild claims

Writer cons:

Requires a lot more setup to get the most from

GPT comes with quite a lot of baggage. OpenAI has been less than transparent about exactly what data was used to create the various versions of GPT-3 and GPT-4, and it's facing various lawsuits over the use of copyrighted material in its training dataset. No one is really denying that protected materials— potentially from pirated databases —were used to train GPT; the question is just whether or not it falls under fair use. 

For most people, this is a nebulous situation filled with edge cases and gray areas. Realistically, it's going to be years before it's all sorted out, and even then, things will have moved on so far that the results of any lawsuit are likely to be redundant. But for businesses that want to use AI writing tools without controversy attached, GPT is a no-go—and will be for the foreseeable future. 

Which is where Writer comes in.

Feature-wise, Writer is much the same as any of my top picks. (Though creating a specific brand voice that's automatically used is an Enterprise-only feature; otherwise, you have to use a lot of checkboxes in the settings to set the tone.) Some features, like the chatbot, are a little less useful than they are in the GPT-powered apps, but really, they're not why you'd choose Writer.

Where it stands out is the transparency around its Palmyra LLM . For example, you can request and inspect a copy of its training dataset that's composed of data that is "distributed free of any copyright restrictions." Similarly, Palmyra's code and model weights (which determines its outputs) can be audited, it can be hosted on your own servers, and your data is kept secure and not used for training by default. As an AI-powered tool, it's as above board as it comes.

In addition to generating text, Writer can work as a company-specific Grammarly-like editor, keeping on top of legal compliance, ensuring you don't make any unsupported claims, and checking that everything matches your style guide—even when humans are writing the text. As someone who routinely has to follow style guides, this seems like an incredibly useful feature. I wasn't able to test it fully since I don't have a personal style guide to input, but Writer correctly fixed things based on all the rules that I set.

In side-by-side comparisons, Writer's text generations sometimes felt a little weaker than the ones from Jasper or Copy.ai, but I suspect a lot of that was down to how things were configured. Writer is designed as a tool for companies to set up and train with their own data, not run right out of the box. I'd guess my random blog posts were a poor test of how it should be used in the real world.

While almost all the tools on this list use GPT, most are pretty vague about which particular version of it they use at any given time. This matters because the most basic version of the GPT-3.5 Turbo API costs $0.002/1K tokens (roughly 750 words), while GPT-4 starts at $0.06/1K tokens, and the most powerful version costs $0.12/1K tokens. All this suggests that most apps may not use GPT-4 in all circumstances, and instead probably rely on one of the more modest (though still great) GPT-3 models for most text generation. 

If having the latest and greatest AI model matters to you, Writesonic is the app for you. Writesonic doesn't hide what AI model it uses. It even allows you to choose between using GPT-3.5 and GPT-4, at least on Business plans. 

Whether the content you create will benefit from the extra power of GPT-4 or not depends. In my experience using GPT-4 through ChatGPT, the latest model is more accurate and, essentially, more sensible in how it responds. If you're churning out low-stakes copy variations for your product listings, you likely won't see much improvement. On the other hand, for long-form original blog posts, it could make a difference. Either way, the transparency in which model you're using at any given time is a huge bonus. 

Feature-wise, Writesonic is much the same as any of the other apps on this list, with a Google Docs-style editor, the option to set a brand voice, a few dozen copy templates, a chatbot, a browser extension, and Surfer integration. It's cool that you can set reference articles when you're generating a blog post, but it introduces the real possibility of inadvertent plagiarism if you aren't careful with how you use it. (Its most offbeat feature is a surprisingly solid AI-powered custom chatbot builder that's due to be spun out into its own app soon.) Overall, it's pretty nice to use and skews more toward SEO-optimized content marketing—but like with all the apps, you can use it to generate whatever you want.

Most of the apps on this list are aimed at professionals, businesses, and anyone else with a budget. The Jasper, Copy.ai, and Anyword plans I considered all started at $49/month. That isn't exactly a hobbyist-friendly sum of money, so if you want to explore AI text generators without spending as much, give Rytr a go.

There's a free plan that's good for 10,000 characters (around 2,500 words) per month, and it includes a lot of the features, like a plagiarism checker, and a few AI-generated images. The Saver plan starts at $9/month and allows you to generate 100,000 characters (around 25,000 words) per month. On that plan, you're also able to generate up to 20 images a month, which many other apps charge extra for. (There's also an unlimited plan for $29/month, but at that point, Writesonic is a better value.)

Feature-wise, there are some trade-offs. Rytr is a little less competent at generating long-form content without you guiding it through the process, and there are fewer templates for specific things. The interface also isn't as polished, and there isn't as much hand-holding to get you started. Still, as Rytr is using GPT like almost all the other apps on this list, you should be able to get it to produce substantially similar output.

Other AI writing tools to consider

With so many AI text-generating tools out there, a few good ones worth considering didn't make this list, only because they didn't meet my initial criteria in some way. If none of the AI writers I chose fit the bill for you, here are a few other options worth looking into:

ChatGPT is surprisingly competent and fun to use. And best of all, it's free. ( Google Bard is a little less excellent on the content production side.) 

Wordtune and Grammarly are both great tools for editing and improving your own writing .  GrammarlyGO just isn't as flexible as my other picks.

Notion AI adds a powerful AI tool directly into Notion. If you already use Notion, it's worth checking out, but it's a lot to learn if you just want a text generator. (Same goes for AI within any other Notion alternative, like Coda AI .)

Surfer and Frase are both AI-powered SEO tools . They fell slightly out of scope for this list, but they can both help you optimize and improve your content—AI-generated or not.

AI content creation tools have become much more accessible and mainstream since the release of ChatGPT and Gemini (previously known as Bard) by Google.

Since then, we have seen an accelerated uptake in the use of AI tools – and especially in AI content generation.

Revisiting an article we wrote pre-ChatGPT, we have reassessed our original list of tools to road-test AI content generators and see how their output compares.

How ChatGPT Is Changing The Content Industry

OpenAI has led the development of large language models and generative AI. In May 2020, GPT-3 was launched, which was a huge leap forward in quality from the predecessor GPT-2.

AI content writers began to improve greatly, and as we reported in the last version of this article, there were several content generator tools that all provided reasonable results.

Then, in November 2022, OpenAI launched ChatGPT and opened up access to GPT-3.5 through an easy-to-access interface.

This resulted in an explosion of interest and uptake in the use of generative AI. By the end of January 2023, ChatGPT had 100 million users and was officially the fastest-growing app in history.

Many of the tools listed below (apart from Gemini) are all based on GPT-3.5 or GPT-4.

Bard (now called Gemini) , developed by Google Deepmind, was launched quickly in response to ChatGPT in February 2023 .

The other main contender is Claude from Anthropic, launched in March 2023 . But, at this time, Claude doesn’t have the mainstream dominance that ChatGPT holds.

Following the introduction of these generative AI tools and their mainstream adoption, there have been plenty of discussions about ethics, the impact on creativity, and the impact on jobs.

In a meta self-referential message, Gemini (Bard) even offers this message in response to the prompt “AI Content Creation.”

The Drawbacks Of Using AI Writers

With easy access to AI content writing tools, the content production industry is changing.

Many websites have adopted AI as a tool for mass production and others are doubling down on the quality of human-written content where AI content generators cannot compare.

Generative AI is causing a lot of disruption in SEO and content creation. In reaction to this, there has been pushback from businesses that this could impact – such as the NYT suing Open AI for training its LLM on their content without approval.

What this means is that, right now, there are unresolved issues of fair use, copyright, privacy, security, and bias. It could result in a dispute over the ownership and copyright of AI-generated content.

There are many legal and ethical issues arising, including the impact on creativity and the jobs it might displace.

At SEJ, we consider generative AI a useful tool to support content writers and SEO professionals but not a replacement for human content writers (see use cases at the end of the article).

Apart from these problems, generative AI also has the following disadvantages:

  • Hallucinations and misinformation. Unless you understand your topic in-depth, you won’t know what you don’t know and cannot take the output from a chatbot for written facts.
  • Writing style can be unnatural, with an unusual choice of words that is jarring to read.
  • Getting the best results takes considerable skill and understanding of writing and using prompts.

Another major flaw is that if everyone is using an AI tool to target the same keywords, then where is the differentiating factor to what you are creating?

What will make your brand stand out and resonate with your audience?

For these reasons, SEJ recommends that you do not use generative AI to create content that you intend to publish. 

How You Can Use AI In Content Marketing

A tool is only as good as the person operating it.

Generative AI can be excellent for productivity and speeding up content production. But, you need someone who knows their subject and is a good writer behind the wheel to get results worthy of using.

A content marketer can truly benefit from generative AI as an efficient tool to make repetitive tasks easier and output faster. In those terms, the use of all kinds of AI will become more and more seamlessly integrated into marketing.

Here are some quick use-case examples specific to content creation and whether generative AI works or doesn’t.

Where AI Content Does Work (with human review):

  • For product descriptions at scale.
  • For meta descriptions at scale.
  • Creating summaries or key points of content.
  • Assisting with brainstorming and idea generation.
  • Creating outlines for content.
  • Improving headlines

Where AI Content Doesn’t Work:

  • Producing well-researched content.
  • Creating data-driven content.
  • Having innovative and fresh ideas.
  • Thought leadership.
  • Writing full articles.
  • Providing sources or facts.

In this article, we will review a selection of the current best content creation tools to see how they compare for illustrative purposes. Even though there are many use cases we don’t suggest, it wouldn’t be prudent to bury our heads in the sand about their capabilities. Let’s look at the results of the tools we tested:

10 AI Content Creation Tools Compared

All the content generator tools we tested were fed the same simple phrase: ‘AI content creation.’

We compared the use of the tool and the quality of the content output. You can see that output in each of the screenshots below.

As part of the comparison, we also ran all the content through Copyscape to check for plagiarism.

What has become apparent in the last few years since the previous version of this article is that ChatGPT and Gemini are set to dominate. Because of this, other AI writing tools will have to offer much more to differentiate and compete against them.

For the purposes of this article, we only tested tools that had a free option available. This list of AI writers is simply a selection of the most popular tools on the market and not our personal recommendation, nor a fully inclusive list of all tools available in the market.

ChatGPT example

ChatGPT is built on GPT-3.5 for free users and GPT-4 for paying subscribers.

ChatGPT is the tool that many of the other AI writers in this list are built on (apart from Gemini) and offers an easy-to-access interface to the powerful GPT LLMs.

The applications of ChatGPT go far beyond just content creation, with its use case experiments being documented almost daily. Learning how to write prompts has become one of the most in-demand skills in the last year.

ChatGPT also has GPTs which are plugin tools that can complete set tasks. A bit like templates or extensions for Sheets or add-ons for Chrome – expect this to become a fast-developing area.

Out of the box, ChatGPT appears easy to use, but the challenge is writing specific and tailored prompts to get the best results.

However, simply typing in “AI content creation” did generate 338 words of a comprehensive description that could be the basis of a human-written article.

The free version is an excellent starting point, and the premium Plus version allows access to the additional tools.

OpenAI provides ChatGPT in varied pricing tiers: ChatGPT Plus at $20/month for individuals, ChatGPT Team at $25 per person/month for teams, and a customizable ChatGPT Enterprise plan for larger organizational needs.

  • Ability to engage in detailed and context-aware conversations.
  • Accessible and easy to use.

2. Gemini (previously Bard)

Gemini (Bard) , by Google Deepmind, is a Large Language Model tool built on the Gemini platform . Much the same as ChatGPT, Gemini is an infinitely powerful tool that has exponential applications.

The potential applications for content producers as a tool to help with content creation are endless. We expect that, between ChatGPT and Gemini, most SEO professionals and content creators will use one of these tools daily.

Gemini is very easy to use with the minimalist interface you would expect from Google.

In output terms, Gemini has different nuances to ChatGPT, as you would expect, built on different models. Using each of the tools on a regular basis highlights where each differs and excels to get the best results.

The output from Gemini is sometimes better than ChatGPT – or just different. However, information can be disjointed, and all information must be fact-checked, as both tools have a tendency to make things up with hallucinations.

One important point to note was that Gemini did flag two results in our Copyscape plagiarism check. ChatGPT did not flag any.

Gemini is available as a free version and Gemini Advance is priced at $19.99 per month just undercutting ChatGPT.

3. Writesonic

Writesonic is built on GPT-4 and is based on facilitating marketing copy, blog articles, and product descriptions. The generator can also provide content ideas and outlines, and has a full suite of templates for different types of content.

Writesonic has a variety of different tools for different purposes, but on the free trial, we didn’t have access to most of them.

We tested the article writing tool, and it was very easy to use. The article read well, but please remember all of the caveats above. This is an interesting test of the tool’s capabilities, but we don’t suggest directly publishing the outputs of generative AI, and it’s our internal policy not to do so.

Writesonic’s unique selling points include integrating with Google Search for more up-to-date content and providing sources.

The platform offers a free version with basic features, while paid plans range from $13 to $500 monthly. Enterprise solutions are available with customized pricing to fit the needs of larger organizations.

  • Features designed for SEO optimization.
  • Support for creating content in 30 different languages.
  • API access, bulk processing, and integrations for scalability and efficiency.

Copy.ai example

Copy.ai is an AI-driven platform that claims to automate various sales and marketing tasks, from cold outreach to content repurposing.

Copy.ai provides templates across a variety of content types, such as blogs, ads, sales, websites, and social media. The generator also provides translation into 25 languages.

Copy.ai differentiates by offering a zero-retention data policy, claiming that user inputs are never retained or used for training purposes, which could be crucial for privacy-conscious organizations. It says it only works with language models that adhere to this strict data policy.

From the three-word phrase input, the tool produced a long article about the subject without any additional prompting.

The quality was good, and we found that it would be difficult to discern that this was machine-generated. The output appears to have improved since we tested it last. Again, this doesn’t change the fact that writing final content outputs is not a use case that we suggest for these tools.

Copy.ai has a free plan, and paid plans range from $36/month for Pro to $3,000/month for Scale.

5. HyperWrite

HyperWrite is an AI-powered writing tool that claims to assist with creating marketing copy, conducting research, and improving overall writing and communication skills. It offers a Chrome extension for ease of use across various web platforms.

Hyperwriter looks a lot like ChatGPT, and the output returned was very similar to what we achieved directly in ChatGPT. Too similar for coincidence.

It would appear that HyperWrite uses the ChatGPT interface with a simple prompt layered onto the phrase we input. From this test, we don’t see any justification to use this tool over ChatGPT.

Free trial available: Premium plan at $19.99 monthly and Ultra plan at $44.99 monthly.

 Rytr example

Rytr is an AI writing assistant that claims to help users create high-quality content quickly and cost-effectively.

Rytr offers over 40 use cases, support for 30+ languages, and more than 20 tones of voice.

We found the tool very easy to use and quickly generated an output. However, the content was not as well-written as other writers tested, and the language output did not feel natural and was obviously AI-generated.

There were a few other tools that were nice to use, and we liked the cute poem creator. But, for the task of producing natural-feeling content, it didn’t quite meet the standard.

Rytr offers a monthly free plan with 10K characters, a “Saver” plan at $9/month, and an “Unlimited” plan at $29/month.

  • Integration with apps like WordPress and Shopify.
  • 30 languages supported.

7. LongShot

LongShot pitches itself as an AI-powered long-form content assistant and is built on a combination of GPT-3 and custom AI models. It tries to clearly separate from being a replacement content writer.

The platform has over 30 tools, including keyword research, rephrasing, and blog ideas, and you can write in 8 languages. Be aware that you should scrutinize any research or fact-checking claims that AI tools make carefully, we have yet to meet an AI tool we would be comfortable using for those purposes without checking the veracity of the outputs in depth.

To use LongShot as a writer, you have to go through a process of selecting suggested headlines before the tool generates an article outline and then a final output.

On a similar level to Copy.ai, LongShot produced an in-depth and relatively well-written article.

LongsShot also includes a feature called FactGPT that is targeted to trending and current topics

The pricing starts with a free trial, a “Pro” plan at $19/month, a ‘Team” plan at $49/month, and customizable pricing for larger needs.

  • Integration with multiple platforms.
  • Supports eight languages.

8. Jasper AI

Jasper AI  claims it will help you write faster, beat writer’s block, and rank better with SEO-optimized content.

They also claim to have consulted with SEO professionals and direct marketing experts to develop how the AI generator writes content.

How to use the new AI writing tool in Google Docs and Gmail

Currently in beta, Help Me Write is a new generative AI writing tool built into Gmail and Google Docs. Here’s how to get the most out of it while avoiding its pitfalls.

Joining the generative AI gold rush, Google last month announced plans to bring several AI-powered tools , collectively called Duet AI , to its Workspace office suite. These features will include automated project planning in Google Sheets, the ability to create images from text prompts in Google Slides, and an automated writing tool in Gmail and Google Docs called “Help Me Write.”

The AI tools in Slides and Sheets are not yet available, but Help Me Write is in limited preview; you can try it out in Google Docs or Gmail on the web by signing up for access to Workspace Labs with your Google account. (You’ll be put on a waitlist before being granted access.) Like the well-known ChatGPT, Help Me Write is a chatbot tool that generates written text based on prompts (instructions) that you give it.

Whether you’re a professional writer or someone who dreads having to write for your job, the potential of AI assistance for your writing tasks is appealing. Help Me Write can indeed write long passages of text that are reasonably readable. But its results come with caveats including factual errors, redundancy, and too-generic prose.

This guide covers how to use Help Me Write in both Google Docs and Gmail to generate and rewrite text, and how to overcome some of the tool’s shortcomings. Because it’s in preview status, keep in mind that there may be changes to its features, and the results it generates, when it’s finally rolled out to the public.

(On a meta note, no part of this article was written by Help Me Write. Many articles about AI include a “twist” in which the author reveals that what you’ve been reading was, in fact, written by an AI. That’s not the case here. A major reason is the question of copyright — who owns the words that are generated by AI, especially if its service is free for public use?)

Use Help Me Write to generate text

Once you’ve been granted access to Workspace Labs, start a new blank document in Docs. At the top of the document is a button that includes a pencil with a + sign and the words “Help me write.” Or, if you open an existing document, you’ll see a small button with the “pencil +” icon at the left edge of your document page. In Gmail, the same icon appears on the toolbar along the bottom of the compose window.

Click this Help me write button. In Docs, the “Help me write” panel opens. In Gmail, a text entry bar appears at the bottom of the compose window.

Inside the panel or bar, you’ll see several suggestions for prompts — words that describe the subject and kind of writing you would like Help Me Write to generate — scroll through. These suggestions, such as “Pitch for a product that allows people to create holograms of themselves” or “An introduction for someone I met at the conference,” give you an idea as to how a prompt is worded.

Type in a prompt. For this guide, we entered “A step-by-step plan for starting a small catering and events coordinator business as a side gig” in Google Docs to prompt a planning document. And in Gmail we requested a business letter with this prompt: “Follow-up to the client recipient asking how satisfied they are with our service, and invite the recipient to respond to me with more questions.”

After you type in your prompt, click Create . Help Me Write will process your prompt, which may take several seconds; it depends on how complex the wording of your prompt request is. Then another panel will open displaying the text it generated, which might be sentences or whole paragraphs.

Below these results are options for starting over or refining the generated text:

Recreate: If you’re not satisfied with the text that Help Me Write generated, clicking this will instruct it to try again using your prompts.

Refine: Selecting this opens a small menu with further options:

Formalize: Help Me Write rewrites the generated text with wording at a higher academic reading level. (Be warned: this may result in prose that’s stilted or excessively wordy.)

Shorten: Help Me Write rewrites the generated text with fewer words.

Elaborate: Help Me Write will generate additional text to provide more details based on your prompts.

Rephrase (in Docs): Help Me Write will paraphrase the text it generated. This action is different from Recreate. When you click Recreate , Help Me Write starts the text generation process over again based on your prompts, but when you select Rephrase , Help Me Write will rewrite the text it already generated.

I’m Feeling Lucky (in Gmail): This is like rolling the dice, where Help Me Write will randomly rewrite your email draft in any number of ways, such as making it longer or more formal, or even arranged as song lyrics.

A client letter in the form of song lyrics is just one of the random results you might get with the “I’m Feeling Lucky” option.

When you’re happy with the text that Help Me Write generated for you, click Insert to add it to your document or email. After you insert the generated text, it becomes regular document text that you can edit as you see fit.

You can use Help Me Write to rewrite your document or email, whether it was originally written by you or generated by Help Me Write.

To use Help Me Write to rewrite in Docs, highlight the text (phrases, sentences, or paragraphs) that you want Help Me Write to rework. Then click the Help me write icon to the left of the highlighted text.

A menu opens with the same “Refine” rewriting options we saw earlier: Formalize , Shorten , Elaborate , Rephrase . There’s also a fifth option on this menu: a “Custom” entry box where you can type in a prompt such as “in an informal voice” or “use simpler wording.”

In Gmail, you can use Help Me Write to rewrite your entire email draft — but unlike in Docs, you cannot have it rewrite individual phrases, sentences, or paragraphs. Click the Help me write icon on the toolbar, and on the menu that opens, you can select Formalize , Elaborate , Shorten , or I’m Feeling Lucky .

Keep caveats in mind and finesse the results

While Help Me Write can give you a head start on your business writing, the text it generates is far from perfect, so it’s important to review and edit its output. Here are some shortcomings to look out for in the results that Help Me Write generates:

Generic content: A lot of the passages that Help Me Write generates read generically, providing only very basic information. Even if you phrase your prompts very specifically, the results may still sound canned.

Redundant content: Help Me Write may generate text that basically says the same thing as text it generated before. This can happen when you have it generate several paragraphs and then instruct it to elaborate on a specific sentence or paragraph. The additional text Help Me Write generates may read similarly to other passages that it’s already generated for you. It may also choose to present this redundant content in a list format.

Similar results for different Google users: Other people using the same or similarly worded prompts with Help Me Write could receive similar results. This is likely to happen if you prompt it to write about a general topic — so two Google users who both prompt Help Me Write to generate text describing how to create a business plan, for example, will probably get results that read nearly alike. The more specific your request, the more likely you’ll be to get unique results.

Factual errors: If you prompt Help Me Write to write about subjects that are based on factual information (such as current business analyses or trends) or of a technical nature, you should scrutinize its results, regardless of how “correct” they may sound. You should conduct further research, searching the web for reliable resources to confirm what Help Me Write has generated.

In addition to fact-checking, you should perform general editing on all the passages that Help Me Write generates. This process includes reading through everything, then adding, rearranging, removing, and rewriting text as you feel is necessary. Practicing the craft of editing on Help Me Write’s output will help you shape your document or email into a final draft that is informative and appealing for other people to read.

A useful collaboration tool

Although you can have Help Me Write generate documents or emails from scratch, it can serve you better if you approach it as a writing assistant. For example, you can prompt Help Me Write to assemble a rough outline for a business proposal or marketing plan that you then flesh out with your own writing.

It can also be useful for collaboration — as a brainstorming tool, for instance. Try collaborating with your co-workers on a shared document, where each person prompts Help Me Write to generate ideas for all to build on.

In fact, your interaction with Help Me Write is itself a form of collaboration. You prompt Help Me Write to generate text, its results may in turn give you ideas for how to approach a topic, and you keep working with the AI to refine those results in your final draft — thus, Help Me Write becomes your collaborator.

AI writing is simply the latest tool in the always-evolving working relationship between people and technology. As long as you understand its rules and limitations, Help Me Write (and other AI-powered writing tools) can be an invaluable aide to kickstarting your writing process or refining what you’ve already written.

Write Like a Pro: How AI Can Turbocharge Your Small Business Marketing

Artificial intelligence tools are revolutionizing the way that businesses approach marketing. Powerful AI software can predict future trends, optimize ROI through targeting and analyze competition. Generative AI is also taking over the creative side of marketing, which includes copywriting, advertising and content creation.

This guide dives into generating written AI content for your business. We compare results from ChatGPT and Google’s Gemini – two of the most popular free tools on the market.

Using AI for different types of marketing content

Generative AI tools such as ChatGPT and Gemini are revolutionizing the way that small business owners generate written content, including copywriting, blog and social media posts, advertising and more. It can also assist in turning your marketing campaign ideas into reality by cutting down on labor-intensive brainstorming, content creation and editing.

Marketing work that previously took days or weeks can now be done in seconds – if you know the right prompts. Creating the right prompt is vital in getting a finished product you are happy with. The prompt process is not a one-and-done task. You need to write a prompt, review the results and then keep tweaking the prompt. In general, the prompt needs to be as detailed as possible.

Advertising copy

With AI tools such as ChatGPT and Gemini, you get a whole advertising team at your fingertips. Brainstorming catchy taglines and other ad copy is as simple as entering the right prompt.

For the example below, we decided to create ad copy for a hair salon. We asked both ChatGPT and Gemini to help by using the following request:

Prompt 1: Create compelling ad copy for my hair salon.

Our analysis: ChatGPT’s response, at 224 words, did include a few useful nuggets. The emojis and hashtags would work well for a social media post. However, we found some of ChatGPT’s wording to be a bit awkward and unspecific. Phrases such as “experience luxury” and “customized creations” could be used to describe a wide variety of products and services.

Our analysis: Gemini’s response clocked in at 241 words and included headlines, ad copy and calls to action. We liked that the upbeat descriptions (“healthy, vibrant, and manageable”) are a bit more specific to hair. The AI tool also added a “bonus” section that anticipated follow-up actions, including offering a discount, posting pictures and further targeting.

But with AI, it often helps to get more specific, especially about your target audience. In the second version of our request, we again asked AI to create ad copy for a hair salon, but for one that serves mostly women. Note that you can change “hair salon” to your type of business, and “women” to your particular target audience.

Prompt 2: Create compelling ad copy for my hair salon targeting women.

Our analysis: ChatGPT’s response, at around 100 words this time, offered a few sound bites that were more women-specific. However, most of the ad still read a bit too mechanical, in our view.

Our analysis: On the other hand, Gemini’s response doubled the length at 200 words, and again included headlines, ad copy and calls to action. We were impressed by Gemini’s wordplay (“unleash your inner goddess” and “help you love your hair again”).

We decided to take the prompt one step further by adding language about prom day.

Prompt 3: Create compelling ad copy for my hair salon targeting women during high school prom season.

Our analysis: This time, at 262 words, ChatGPT provided a slightly longer response than Gemini. It also seemed to possess a better understanding of what prom entails, with specific copy about styles to “match your prom dress” and an upsell for makeup.

Our analysis: Gemini’s copy fell a bit short of being prom-specific. Phrases like “shine brighter than a disco ball” seemed a bit odd. However, the AI did helpfully suggest partnering with local dress shops and makeup artists for a prom package deal.

For our final prompt iteration, we gathered the best aspects of the previous drafts to craft a much more specific request:

Prompt 4:   Create compelling ad copy for my hair salon targeting 16-18-year-old women during high school prom season. Use a positive, upbeat tone and include appropriate social media hashtags. Emphasize that our stylists have experience with all hair types and follow the latest trends in fashion. At the end, mention that we offer package deals for makeup as well.

Our analysis: WIth this added detail, both AI chatbots came back with more concise copy. ChatGPT’s 188-word reply to this prompt was its best yet, in our opinion. However, Gemini’s 156-word response was its shortest, and perhaps a little less punchy than its previous attempts. In this case, getting more specific with the prompt dramatically improved ChatGPT’s output, while Gemini’s seemed to regress.

Overall, we preferred Gemini for writing advertising copy. Google’s AI program generated a more compelling ad with less direction, while ChatGPT needed much more detailed input before providing a satisfactory result.

Product descriptions

Next, we challenged AI to write a compelling product description. In this case, we decided to market protein powder targeted primarily toward male bodybuilders (again, you can tailor this prompt to your own business).

For the first iteration, we used this simple query:

Prompt 1: Using SEO best practices, generate a product description for protein powder targeted toward male bodybuilders.

Our analysis: Again, ChatGPT’s 280-word response is well-formatted for social media, although we found its reply to be overly generalized. It also seemed that ChatGPT misunderstood our query, writing that our protein powder was “engineered with SEO best practices” and that “our product description ensures that you 
 get top-notch information”). Clearly, this underscores the need to review AI’s output.

Gemini product description

Our analysis: Google’s Gemini had a much easier time answering our prompt. Although the description itself only comes in at 158 words, note that the AI incorporated keywords in a more natural-sounding manner. We liked that Gemini got specific with its description, writing that the product contained 25 grams of protein per serving, and was free from artificial flavors, sweeteners, and fillers.

In our second iteration, we tried a significantly longer prompt, asking for more specific details on the product. We also rephrased the section on SEO to avoid the errors of the first prompt.

Prompt 2: Generate a product description for protein powder targeted to male bodybuilders in the 18-40 age range. Use strong, powerful language. Create bullet points based on the technical aspects of the product, including that it has 25 grams of whey protein per serving and is free from artificial flavors, sweeteners, and fillers. Add other appropriate details that buyers may want to know about. Be sure to follow SEO best practices when writing the description to maximize discoverability on platforms such as Amazon.

Our analysis: In some respects, ChatGPT went a bit overboard with our instruction for “strong, powerful language” for “male bodybuilders in the 18-40 age range.” We would have preferred a description that didn’t explicitly mention our target demographic. ChatGPT’s answer also lacked some of the technical language incorporated by Gemini.

Our analysis: Like ChatGPT, we didn’t think it was necessary for Gemini to outright state the target audience in its description. However, we did appreciate that Gemini included more of the product’s technical aspects, and also provided suggestions for other elements to include in the description.

Instead of rewriting the whole prompt, we simply asked the chatbots to remove the bits that we found undesirable and substitute them with something else. In this case, we wanted a product that could appeal to a wider audience, while retaining much of the language intended for our target demographic.

Prompt 3: Write the same article again, but remove the reference to male bodybuilders aged 18-40 and substitute it with more general language.

Our analysis: For both ChatGPT and Gemini, we found this final iteration to be much stronger than our initial prompt. The descriptions contained both compelling ad copy and a strong description of the product’s technical aspects.

Like our previous exercise in writing advertising copy, Gemini provided better initial results using a much shorter prompt. We also liked that Gemini gave us suggestions for improvement that we hadn’t yet thought about. However, once we provided a more detailed prompt, we found that both ChatGPT and Gemini produced similar results.

Social media posts

Many small businesses, especially those in food or retail, are highly visual in nature. In the age of Instagram, eye-catching photography can make or break a new restaurant or e-commerce business.

To ensure that your social media posts reach the right audience, it is equally important to write an attention-grabbing description and use appropriate hashtags.

In this example, we asked ChatGPT and Gemini to think up a description for a social media post that encourages people to drop by our coffee shop on a Wednesday.

Prompt 1:   Write a description for a social media post encouraging people to come to my coffee shop on Wednesday. Include 30 relevant hashtags.

Our analysis: Here, we think both tools offered some interesting content. ChatGPT’s answer felt more like a modern Instagram post, complete with appropriate emojis and a call to tag friends. We liked that the AI reminded you to include both your business’s address and operating hours in the post. Gemini’s output was noticeably shorter but could work well if you needed a more basic description.

For our second iteration of the coffee shop prompt, we added more detail about location, amenities and food/beverage offerings.

Prompt 2: Write an uplifting description for a social media post encouraging people to come to my coffee shop near Boston University on Wednesday. My shop offers free Wi-Fi, pastries, sandwiches, and a variety of specialty coffees. The target audience includes remote workers, students, and workers from nearby office buildings. Include 30 relevant hashtags and appropriate emojis.

Our analysis: Again, we preferred the response from ChatGPT, which generated a more exciting description and made better use of emojis than Gemini.

For generating social media post descriptions, we would give the edge to ChatGPT. This was the case with both long and short prompts. Meanwhile, Gemini’s output was less detailed and didn’t incorporate emojis as well as ChatGPT’s response.

Search engine optimization (SEO) remains one of the top avenues for small businesses to bring in customers. SEO refers to the best practices for getting your product or service to rank higher in search results. This can help drive organic traffic to your site or listing at no cost.

Today’s AI tools take the pain out of writing SEO content . We asked ChatGPT and Gemini to write an SEO-optimized blog post for a local car mechanic on the importance of oil changes.

Prompt 1:   Using SEO best practices, write a 500-word blog post for an auto mechanic business that talks about the importance of regular oil changes.

Our analysis: ChatGPT’s article isn’t necessarily wrong, but we found it less readable and organized than Gemini’s post. Gemini’s article featured a modern blog layout designed for readability. We liked that the blog post clearly explained the purpose and benefits of regular oil changes, as well as the consequences of skipping them. The article also included a clear call to action.

Expanding on the first prompt, we asked the chatbots to emphasize the importance of oil changes in a wintry city (in this case, Detroit). We also wanted to ensure that potential customers could get value from the blog post by using non-technical language.

Prompt 2: Write a 500-word blog post for an auto mechanic business that talks about the importance of regular oil changes. Make sure that the content is relevant to customers in Detroit, which experiences a harsh winter. Use language that is easy for non-mechanics to understand. Explain the purpose and benefits of regular oil changes, and why you shouldn’t skip them. Include a clear call to action.

ChatGPT optimized blog post

Our analysis: With this longer prompt, ChatGPT did a better job optimizing the post for readability and covering the most important aspects of oil changes. However, we still found the description to be a bit vague.

Gemini blog post

Our analysis: Not only did Gemini replicate the thorough article of the previous prompt, but it also excelled in incorporating the importance of doing oil changes for the winter. Gemini directly addressed the technical aspects of why oil changes help a car run better during winter.

We were especially impressed by Gemini’s blog post attempt, which clearly explained the benefits of keeping up with oil changes (and the negative consequences of failing to do so). Gemini also did a good job of addressing our request to emphasize weather-related benefits, while ChatGPT only vaguely referenced winter in Detroit.

How to get the most out of AI

Based on our experience using AI to write marketing content, we came away with a few actionable insights for small business owners.

Use multiple chatbots

Not all chatbots are built the same. We found that Gemini performed better with little direction, and generally produced more compelling and organized pieces compared with ChatGPT. However, ChatGPT clearly outperformed Gemini when it came to crafting social media posts.

Proofread everything

It should go without saying that business owners should closely examine any output from generative AI programs. We found that the way we posed certain questions confused the chatbot. AI’s phrasing also remained somewhat awkward in many instances. Human reviewers are still needed to check for errors and odd wording.

Write longer prompts

Oftentimes, generative AI programs perform better when they are provided with more detail. We started with basic prompts and continued iterating until we found a set of instructions that produced the most accurate results.

Provide feedback for the chatbot

Another helpful technique is to “talk” with the chatbot about its output. Tell ChatGPT or Gemini what you liked or didn’t like, and ask for a new response based on your feedback.

How to Resist the Temptation of AI When Writing

Whether you're a student, a journalist, or a business professional, knowing how to do high-quality research and writing using trustworthy data and sources, without giving in to the temptation of AI or ChatGPT , is a skill worth developing.

As I detail in my book Writing That Gets Noticed , locating credible databases and sources and accurately vetting information can be the difference between turning a story around quickly or getting stuck with outdated information.

For example, several years ago the editor of Parents.com asked for a hot-take reaction to country singer Carrie Underwood saying that, because she was 35, she had missed her chance at having another baby. Since I had written about getting pregnant in my forties, I knew that as long as I updated my facts and figures, and included supportive and relevant peer-reviewed research, I could pull off this story. And I did.

The story ran later that day , and it led to other assignments. Here are some tips I’ve learned that you should consider mastering before you turn to automated tools like generative AI to handle your writing work for you.

Identify experts, peer-reviewed research study authors, and sources who can speak with authority—and ideally, offer easily understood sound bites or statistics on the topic of your work. Great sources include professors at major universities and media spokespeople at associations and organizations.

For example, writer and author William Dameron pinned his recent essay in HuffPost Personal around a statistic from the American Heart Association on how LGBTQ people experience higher rates of heart disease based on discrimination. Although he first found the link in a secondary source (an article in The New York Times ), he made sure that he checked the primary source: the original study that the American Heart Association gleaned the statistic from. He verified the information, as should any writer, because anytime a statistic is cited in a secondary source, errors can be introduced.

Jen Malia, author of  The Infinity Rainbow Club  series of children’s books (whom I recently interviewed on my podcast ), recently wrote a piece about dinosaur-bone hunting for Business Insider , which she covers in her book Violet and the Jurassic Land Exhibit.

After a visit to the Carnegie Museum of Natural History in Pittsburgh, Pennsylvania, Malia, whose books are set in Philadelphia, found multiple resources online and on the museum site that gave her the history of the Bone Wars , information on the exhibits she saw, and the scientific names of the dinosaurs she was inspired by. She also used the Library of Congress’ website, which offers digital collections and links to the Library of Congress Newspaper Collection.

Malia is a fan of searching for additional resources and citable documents with Google Scholar . “If I find that a secondary source mentions a newspaper article, I’m going to go to the original newspaper article, instead of just stopping there and quoting,” she says.

Your local public library is a great source of free information, journals, and databases (even ones that generally require a subscription and include embargoed research). For example, your search should include everything from health databases ( Sage Journals , Scopus , PubMed) to databases for academic sources and journalism ( American Periodical Series Online , Statista , Academic Search Premier ) and databases for news, trends, market research, and polls (t he Harris Poll , Pew Research Center , Newsbank , ProPublica ).

Even if you find a study or paper that you can’t access in one of those databases, consider reaching out to the study’s lead author or researcher. In many cases, they’re happy to discuss their work and may even share the study with you directly and offer to talk about their research.

For journalist Paulette Perhach’s article on ADHD in The New York Times, she used Epic Research to see “dual team studies.” That's when two independent teams address the same topic or question, and ideally come to the same conclusions. She recommends locating research and experts via key associations for your topic. She also likes searching via Google Scholar but advises filtering it for studies and research in recent years to avoid using old data. She suggests keeping your links and research organized. “Always be ready to be peer-reviewed yourself,” Perhach says.

When you are looking for information for a story or project, you might be inclined to start with a regular Google search. But keep in mind that the internet is full of false information, and websites that look trustworthy can sometimes turn out to be businesses or companies with a vested interest in you taking their word as objective fact without additional scrutiny. Regardless of your writing project, unreliable or biased sources are a great way to torpedo your work—and any hope of future work.

Author Bobbi Rebell researched her book Launching Financial Grownups using the IRS’ website . “I might say that you can contribute a certain amount to a 401K, but it might be outdated because those numbers are always changing, and it’s important to be accurate,” she says. “AI and ChatGPT can be great for idea generation,” says Rebell, “but you have to be careful. If you are using an article someone was quoted in, you don’t know if they were misquoted or quoted out of context.”

If you use AI and ChatGPT for sourcing, you not only risk introducing errors, you risk introducing plagiarism—there is a reason OpenAI, the company behind ChatGPT, is being sued for downloading information from all those books.

Audrey Clare Farley, who writes historical nonfiction, has used a plethora of sites for historical research, including Women Also Know History , which allows searches by expertise or area of study, and JSTOR , a digital library database that offers a number of free downloads a month. She also uses Chronicling America , a project from the Library of Congress which gathers old newspapers to show how a historical event was reported, and Newspapers.com (which you can access via free trial but requires a subscription after seven days).

When it comes to finding experts, Farley cautions against choosing the loudest voices on social media platforms. “They might not necessarily be the most authoritative. I vet them by checking if they have a history of publication on the topic, and/or educational credentials.”

When vetting an expert, look for these red flags:

  • You can’t find their work published or cited anywhere.
  • They were published in an obscure journal.
  • Their research is funded by a company, not a university, or they are the spokesperson for the company they are doing research for. (This makes them a public relations vehicle and not an appropriate source for journalism.)

And finally, the best endings for virtually any writing, whether it’s an essay, a research paper, an academic report, or a piece of investigative journalism, circle back to the beginning of the piece, and show your reader the transformation or the journey the piece has presented in perspective.

As always, your goal should be strong writing supported by research that makes an impact without cutting corners. Only then can you explore tools that might make the job a little easier, for instance by generating subheads or discovering a concept you might be missing—because then you'll have the experience and skills to see whether it's harming or helping your work.

As you can see, after you’ve selected one of the titles our AI has given you, the tool will automatically generate an intro . It’s actually supposed to also give you an outline — sorry, sometimes the tool doesn’t work perfectly yet, but here’s what I got when I ran it again:

Awesome! Now, I can easily pick from or even combine both of the intros I’ve gotten from the AI, to start writing from there. I can also pick and choose from the sections that the AI suggested to me in the form of the outline (the underlying technology is GPT-3, by the way).

Next, all I had to do was write the above explanation, and leave you with my final thoughts (based on the suggestions from our AI content generator).

We live in a world where anything seems possible with artificial intelligence. While there are significant benefits to AI in certain industries, such as healthcare , a darker side has also emerged. It has increased the risk of bad actors mounting new types of cyber-attacks, as well as manipulating audio and video for fraud and virtual kidnapping. Among these malicious acts, are deepfakes, which have become increasingly prevalent with this new technology.

What are deepfakes?

Deepfakes use AI and machine learning (AI/ML) technologies to produce convincing and realistic videos, images, audio, and text showcasing events that never occurred. At times, people have used it innocently, such as when the Malaria Must Die campaign created a video featuring legendary soccer player David Beckham appearing to speak in nine different languages to launch a petition to end malaria.

However, given people’s natural inclination to believe what they see, deepfakes do not need to be particularly sophisticated or convincing to effectively spread misinformation or disinformation .

According to the U.S. Department of Homeland Security, the spectrum of concerns surrounding ‘synthetic media’ ranged from “an urgent threat” to “don’t panic, just be prepared.”

The term “deepfakes” originates from how the technology behind this form of manipulated media, or “fakes,” relies on deep learning methods. Deep learning is a branch of machine learning, which in turn is a part of artificial intelligence. Machine learning models use training data to learn how to perform specific tasks, improving as the training data becomes more comprehensive and robust. Deep learning models, however, go a step further by automatically identifying the data’s features that facilitate its classification or analysis, training at a more profound, or “deeper,” level.

The data can include images and videos of anything, as well as audio and text. AI-generated text represents another form of deepfake that poses an increasing problem. While researchers have pinpointed several vulnerabilities in deepfakes involving images, videos, and audio that help in their detection, identifying deepfake text proves to be more difficult.

How do deepfakes work?

Some of the earliest forms of deepfakes were seen in 2017 when the face of Hollywood star Gal Gadot was superimposed onto a pornographic video. Motherboard reported at the time that it was allegedly the work of one person—a Redditor who goes by the name ‘deepfakes.’

The anonymous Reddit user told the online magazine that the software relies on multiple open-source libraries, such as Keras with a TensorFlow backend. To compile the celebrities’ faces, the source mentioned using Google image search, stock photos, and YouTube videos. Deep learning involves networks of interconnected nodes that autonomously perform computations on input data. After sufficient ‘training,’ these nodes then organize themselves to accomplish specific tasks, like convincingly manipulating videos in real-time.

These days, AI is being used to replace one person’s face with another’s on a different body. To achieve this, the process might use Encoder or Deep Neural Network (DNN) technologies. Essentially, to learn how to swap faces, the system uses an autoencoder that processes and maps images of two different people (Person A and Person B) into a shared, compressed data representation using the same settings.

After training the three networks, to replace Person A’s face with Person B’s, each frame of Person A’s video or image is processed by a shared encoder network and then reconstructed using Person B’s decoder network.

Now, apps such as FaceShifter, FaceSwap, DeepFace Lab, Reface, and TikTok make it easy for users to swap faces. Snapchat and TikTok, in particular, have made it simpler and less demanding in terms of computing power and technical knowledge for users to create various real-time manipulations.

A recent study by Photutorial states that there are 136 billion images on Google Images and that by 2030, there will be 382 billion images on the search engine. This means that there are more opportunities than ever for criminals to steal someone’s likeness.

Are deepfakes illegal?

With that being said, unfortunately, there have been a swathe of sexually explicit images of celebrities. From Scarlett Johannson to Taylor Swift, more and more people are being targeted. In January 2024, deepfake pictures of Swift were reportedly viewed millions of times on X before they were pulled down.

Woodrow Hartzog, a professor at Boston University School of Law specializing in privacy and technology law, stated: “This is just the highest profile instance of something that has been victimizing many people, mostly women, for quite some time now.”

Speaking to Billboard, Hartzog said it was a “toxic cocktail”, adding: “It’s an existing problem, mixed with these new generative AI tools and a broader backslide in industry commitments to trust and safety.”

In the U.K., starting from January 31, 2024, the Online Safety Act has made it illegal to share AI-generated intimate images without consent. The Act also introduces further regulations against sharing and threatening to share intimate images without consent.

However, in the U.S., there are currently no federal laws that prohibit the sharing or creation of deepfake images, but there is a growing push for changes to federal law. Earlier this year, when the UK Online Safety Act was being amended, representatives proposed the No Artificial Intelligence Fake Replicas And Unauthorized Duplications (No AI FRAUD) Act.

The bill introduces a federal framework to safeguard individuals from AI-generated fakes and forgeries, criminalizing the creation of a ‘digital depiction’ of anyone, whether alive or deceased, without consent. This prohibition extends to unauthorized use of both their likeness and voice.

The threat of deepfakes is so serious that Kent Walker , Google’s president for global affairs, said earlier this year: “We have learned a lot over the last decade and we take the risk of misinformation or disinformation very seriously.

“For the elections that we have seen around the world, we have established 24/7 war rooms to identify potential misinformation. ”

Ever since OpenAI launched ChatGPT in November 2023, everyone's been talking about — and trying out — the hot new tech in their personal and professional lives.

That includes some of the world's most influential business leaders.

Many companies aside from OpenAI have released generative AI products with human-like capabilities to cash in on the hype. Users have been turning to the technology to save time and reach their goals.

Some workers have used ChatGPT to generate lesson plans , produce marketing materials, and write legal briefs. Others have turned to chatbots to help them lose weight , do homework, and plan vacations. Some even claimed they made money with AI.

And interest has also permeated the C-suite, with leaders just as keen to make the technology work for them. From translating poetry to creating rap songs, here's how executives from Meta, Google, Microsoft, and other major companies have personally used AI.

Nvidia's Jensen Huang said he uses Perplexity AI "almost every day."

The CEO of the chip company that makes highly coveted GPUs to power AI models uses the AI-powered question-and-answer search engine for research, he told Wired in February this year.

In the interview, he gave an example of how Perplexity can be used to learn about recent advancements in computer-aided drug discovery.

"You want to frame the overall topic so that you could have a framework," Huang told Wired. "From that framework, you could ask more and more specific questions."

"I really love that about these large language models," he said.

The CEO said he uses OpenAI's ChatGPT as well.

AMD CEO Lisa Su said she uses Microsoft's Copilot to "summarize meetings" and "track actions."

Still, Su doesn't think Microsoft's AI assistant is perfect.

"It doesn't write my emails so well," the CEO of Nvidia competitor AMD said during her SXSW keynote in March 2024. "I don't use it for that."

Microsoft has integrated Copilot into its suite of office products, including PowerPoint, Word, and Excel.

Microsoft CEO Satya Nadella said his favorite way to use ChatGPT is to explain German philosophy and Persian poetry.

Nadella said ChatGPT helps him comprehend complicated texts from philosophers like Martin Heidegger.

"I remember my father trying to read Heidegger in his forties and struggling with it, and I have attempted it a thousand times and failed," the CEO said on a June 2023 episode of Freakonomics Radio . "But I must say going and asking ChatGPT or Bing chat to summarize Heidegger is the best way to read Heidegger."

He was also impressed by the AI chatbot's ability to translate poetry. He said his favorite prompt is asking ChatGPT to translate Rumi from Urdu into English.

"The most interesting thing about it is that it captures the depth of poetry," Nadella said on the podcast. "It somehow finds, in that latent space, meaning that's beyond just the words and the translation. That I find is just phenomenal."

Venture capitalist Vinod Khosla said he used ChatGPT to write a rap for his daughter's wedding.

"I wrote what I wanted to say to her as a speech, entered it into ChatGPT, said, 'Do rap lyrics for it,' it did, and then entered it into a music AI," the OpenAI investor posted on X, formerly Twitter, in October 2023.

"So I was able to blare it over the speakers, a personal rap song from me," Khosla added. "It extended my capability. It meant a lot to me."

He's the founder of Khosla Ventures, a VC investing in startups in AI, clean technology, and biomedicine, among other sectors.

CEO and cofounder of OpenAI Sam Altman said he uses his company's chatbot for translation and writing.

In August 2023, Altman told Bloomberg that ChatGPT was a "life saver" for translation purposes during his world tour, where he discussed the future of AI. Over three months, he visited countries like Israel, Jordan, Qatar, the UAE, India, and South Korea.

The face behind ChatGPT said his creation helps him "write faster" and "think more."

"I see the path towards, like, this being my super assistant for all of my cognitive work," he told Bloomberg.

Sundar Pichai, CEO of Google, said he used a language model to talk to the planet Pluto with his son.

In an episode of the New York Times' tech podcast " Hard Fork," Pichai said he asked LaMDA, one of the search giant's early conversational AI models, to pretend it was the planet Pluto to test its capabilities.

During one conversation, LaMDA told Pichai and his son that Pluto is "really lonely" because it's so far out in space.

"I felt sad at that point talking to it," the CEO said on the March 2023 episode of the podcast.

He also asked LaMDA what he should do for his father's 80th birthday. In response, the model suggested that he make a scrapbook.

"It's not that it's profound, but it says things and kind of sparks the imagination," he told the NYT when describing the prompt.

Google unveiled Gemini, its latest language model that could generate text and photos using prompts, in December 2023.

Billionaire investor Warren Buffett said he used ChatGPT to translate the Frank Sinatra song 'My Way' into Spanish.

The chairperson of Berkshire Hathaway seemed to be satisfied with the output.

"Two seconds later, you know, it comes out" and "rhymes and does all these wonderful things," Buffett told CNBC on April 2023 regarding the song.

While the billionaire said he sees the potential for ChatGPT to save time, he was skeptical about whether it could positively impact society.

"I think this is extraordinary, but I don't know if it's beneficial," he told CNBC.

Tim Cook, CEO of Apple, said he uses ChatGPT in his personal life.

Cook didn't specify how he uses the AI chatbot. He did, however, say that he sees its potential after trying it out.

"I'm excited about it," he told CNBC in a June 2023 interview. "I think there's some unique applications for it and you can bet that it's something that we're looking at closely."

Apple appears to be lagging behind some other Big Tech players on the AI front. The iPhone maker is expected to discuss its AI projects during its June developer conference.

Meta CEO Mark Zuckerberg built a personal AI assistant called "Jarvis" to manage different parts of his home.

A.I.-Generated Garbage Is Polluting Our Culture

Increasingly, mounds of synthetic A.I.-generated outputs drift across our feeds and our searches. The stakes go far beyond what’s on our screens. The entire culture is becoming affected by A.I.’s runoff, an insidious creep into our most important institutions.

Consider science. Right after the blockbuster release of GPT-4, the latest artificial intelligence model from OpenAI and one of the most advanced in existence, the language of scientific research began to mutate. Especially within the field of A.I. itself.

A study published this month examined scientists’ peer reviews — researchers’ official pronouncements on others’ work that form the bedrock of scientific progress — across a number of high-profile and prestigious scientific conferences studying A.I. At one such conference, those peer reviews used the word “meticulous” more than 34 times as often as reviews did the previous year. Use of “commendable” was around 10 times as frequent, and “intricate,” 11 times. Other major conferences showed similar patterns.

Such phrasings are, of course, some of the favorite buzzwords of modern large language models like ChatGPT. In other words, significant numbers of researchers at A.I. conferences were caught handing their peer review of others’ work over to A.I. — or, at minimum, writing them with lots of A.I. assistance. And the closer to the deadline the submitted reviews were received, the more A.I. usage was found in them.

If this makes you uncomfortable — especially given A.I.’s current unreliability — or if you think that maybe it shouldn’t be A.I.s reviewing science but the scientists themselves, those feelings highlight the paradox at the core of this technology: It’s unclear what the ethical line is between scam and regular usage. Some A.I.-generated scams are easy to identify, like the medical journal paper featuring a cartoon rat sporting enormous genitalia. Many others are more insidious, like the mislabeled and hallucinated regulatory pathway described in that same paper — a paper that was peer reviewed as well (perhaps, one might speculate, by another A.I.?).

What about when A.I. is used in one of its intended ways — to assist with writing? Recently, there was an uproar when it became obvious that simple searches of scientific databases returned phrases like “As an A.I. language model” in places where authors relying on A.I. had forgotten to cover their tracks. If the same authors had simply deleted those accidental watermarks, would their use of A.I. to write their papers have been fine?

What’s going on in science is a microcosm of a much bigger problem. Post on social media? Any viral post on X now almost certainly includes A.I.-generated replies, from summaries of the original post to reactions written in ChatGPT’s bland Wikipedia-voice, all to farm for follows. Instagram is filling up with A.I.-generated models, Spotify with A.I.-generated songs. Publish a book? Soon after, on Amazon there will often appear A.I.-generated “workbooks” for sale that supposedly accompany your book (which are incorrect in their content; I know because this happened to me). Top Google search results are now often A.I.-generated images or articles. Major media outlets like Sports Illustrated have been creating A.I.-generated articles attributed to equally fake author profiles. Marketers who sell search engine optimization methods openly brag about using A.I. to create thousands of spammed articles to steal traffic from competitors.

Then there is the growing use of generative A.I. to scale the creation of cheap synthetic videos for children on YouTube. Some example outputs are Lovecraftian horrors, like music videos about parrots in which the birds have eyes within eyes, beaks within beaks, morphing unfathomably while singing in an artificial voice, “The parrot in the tree says hello, hello!” The narratives make no sense, characters appear and disappear randomly, and basic facts like the names of shapes are wrong. After I identified a number of such suspicious channels on my newsletter, The Intrinsic Perspective, Wired found evidence of generative A.I. use in the production pipelines of some accounts with hundreds of thousands or even millions of subscribers.

As a neuroscientist, this worries me. Isn’t it possible that human culture contains within it cognitive micronutrients — things like cohesive sentences, narrations and character continuity — that developing brains need? Einstein supposedly said : “If you want your children to be intelligent, read them fairy tales. If you want them to be very intelligent, read them more fairy tales.” But what happens when a toddler is consuming mostly A.I.-generated dream-slop? We find ourselves in the midst of a vast developmental experiment.

There’s so much synthetic garbage on the internet now that A.I. companies and researchers are themselves worried, not about the health of the culture, but about what’s going to happen with their models. As A.I. capabilities ramped up in 2022, I wrote on the risk of culture’s becoming so inundated with A.I. creations that when future A.I.s are trained, the previous A.I. output will leak into the training set, leading to a future of copies of copies of copies, as content became ever more stereotyped and predictable. In 2023 researchers introduced a technical term for how this risk affected A.I. training: model collapse . In a way, we and these companies are in the same boat, paddling through the same sludge streaming into our cultural ocean.

With that unpleasant analogy in mind, it’s worth looking to what is arguably the clearest historical analogy for our current situation: the environmental movement and climate change. For just as companies and individuals were driven to pollute by the inexorable economics of it, so, too, is A.I.’s cultural pollution driven by a rational decision to fill the internet’s voracious appetite for content as cheaply as possible. While environmental problems are nowhere near solved, there has been undeniable progress that has kept our cities mostly free of smog and our lakes mostly free of sewage. How?

Before any specific policy solution was the acknowledgment that environmental pollution was a problem in need of outside legislation. Influential to this view was a perspective developed in 1968 by Garrett Hardin, a biologist and ecologist. Dr. Hardin emphasized that the problem of pollution was driven by people acting in their own interest, and that therefore “we are locked into a system of ‘fouling our own nest,’ so long as we behave only as independent, rational, free-enterprisers.” He summed up the problem as a “tragedy of the commons.” This framing was instrumental for the environmental movement, which would come to rely on government regulation to do what companies alone could or would not.

Once again we find ourselves enacting a tragedy of the commons: short-term economic self-interest encourages using cheap A.I. content to maximize clicks and views, which in turn pollutes our culture and even weakens our grasp on reality. And so far, major A.I. companies are refusing to pursue advanced ways to identify A.I.’s handiwork — which they could do by adding subtle statistical patterns hidden in word use or in the pixels of images.

A common justification for inaction is that human editors can always fiddle around with whatever patterns are used if they know enough. Yet many of the issues we’re experiencing are not caused by motivated and technically skilled malicious actors; they’re caused mostly by regular users’ not adhering to a line of ethical use so fine as to be nigh nonexistent. Most would be uninterested in advanced countermeasures to statistical patterns enforced into outputs that should, ideally, mark them as A.I.-generated.

That’s why the independent researchers were able to detect A.I. outputs in the peer review system with surprisingly high accuracy: They actually tried. Similarly, right now teachers across the nation have created home-brewed output-side detection methods , like adding hidden requests for patterns of word use to essay prompts that appear only when copied and pasted.

In particular, A.I. companies appear opposed to any patterns baked into their output that can improve A.I.-detection efforts to reasonable levels, perhaps because they fear that enforcing such patterns might interfere with the model’s performance by constraining its outputs too much — although there is no current evidence this is a risk. Despite public pledges to develop more advanced watermarking, it’s increasingly clear that the companies are dragging their feet because it goes against the A.I. industry’s bottom line to have detectable products.

To deal with this corporate refusal to act we need the equivalent of a Clean Air Act: a Clean Internet Act. Perhaps the simplest solution would be to legislatively force advanced watermarking intrinsic to generated outputs, like patterns not easily removable. Just as the 20th century required extensive interventions to protect the shared environment, the 21st century is going to require extensive interventions to protect a different, but equally critical, common resource, one we haven’t noticed up until now since it was never under threat: our shared human culture.
